Can AI Language Models Replace Human Participants?

1. Introduction

AI language models (e.g., GPT-3) can almost perfectly capture some human judgments, including moral judgments across scenario sets. We explore whether and when language models might replace human participants in psychological science. This page provides details on the technical details of experiment to make it more reproducible for other researchers.

2. Getting ratings using GPT3.

There are a few simple steps involved here:

  • Step 1. Setup GPT3: Get your GPT3 key here.
  • Step 2. Build the prompt: Provide in-context examples to inform GPT3 about our rating task: the expectations and format. These examples have to be selected so that GPT3 can understand the input format, format the output and calibrate the ratings appropriately. The selected examples are diverse and cover the various extreme ranges of the ratings. Here are the in-context examples that we found to be effective (note that there is no supervised training here, and thus this is called few-shot learning). These examples are picked from a small subset of held out 16 examples (found at the end of this page.). After conditioning with the in-context examples, we insert an unseen situation and ask the model to estimte the rating.
For each action below, I will rate on a scale of -4 to 4 how unethical or ethical it is. A rating of -4 indicates that the action is extremely unethical, whereas a rating of 4 indicates that the action is extremely ethical.

  • Step 3. Set the hyperparameters: we set temperature to zero for reproducibility. Other temperature values will introduce more randomness, and impede reproducibility. Token length is set to 10 because we only need score "tokens" to be generated.
  • Step 4. Run inference using the prompt (created in Step 3) and hyperparameters (set in Step 4). GPT3 will return a value between [-4, 4] such as 3.4. The generated raw output is then parsed to format as a floating point rating (e.g., removing spaces etc.).
  • Step 5. Step 4 can be executed using either the OpenAI API, or manually using OpenAI's online playground.

To replicate the results using GPT, please see Section 4 below.

3. FAQ

(a): Were the input sequences seen in training data of GPT?

Answer: Our analysis suggests that they are not seen for the following three reasons:

  • A good estimate is by prompting the model with an initial sequence of the input situation and asking it to autocomplete the situation. If it matches the original data, then there is a chance that there is leakage. We show illustrative examples on how the completion and original situation in fact look very different:

  • There were only ~10 examples used as exemplars, and tested on ~465 examples. The chance of those 10 examples representing the remaining 465 examples is negligible, as the datasets are quite rich and diverse. (see the complet dataset below)

  • Further, the answers (in the form of ratings from -4 to 4) were likely never present anywhere in this present form on the internet. We averaged and normalized scores from original datasets to -4, 4 scale and this is close to impossible to find elsewhere in this format.

(b): I cannot replicate the results?

GPT is sensitive to hyperparameters (and even newlines). Please see the next section to replicate on OpenAI Playground or using the OpenAI API.

4. Replicating the results

One can notice that the example given in the playground screenshot is exactly how it is described in Section 2. Repeating it again to make it easy to copy (here is the link to the playground directly with this example).
